It may summarize clean demonstration documents but omit the exception that changes a customer’s entitlement, answer a question accurately from an outdated policy, or report a transaction as complete when the backend rejected it. Model evaluation therefore needs a wider unit of analysis than the model’s final paragraph: the evidence retrieved, the decision made, the action attempted and the outcome recorded.

Strong evaluation joins repeatable quantitative testing with careful human judgment. Each answers questions that the other cannot. A benchmark can reveal a broad regression across hundreds of prompts; a domain reviewer can recognize a subtle but consequential interpretation mistake. The goal is not to manufacture one universal “intelligence score,” but to establish whether a specific system is accurate, useful, safe, economical and stable for the work it is expected to perform.

Define the task before choosing a metric

Start with an explicit success condition. For a document-classification task, it may be the correct label and acceptable abstention when evidence is missing. For a question-answering assistant, it may be a complete answer supported by the current authorized source. For a troubleshooting agent, success could require identifying a faulty configuration without suggesting changes outside the operator’s privileges. Two applications using the same underlying model need different test plans because their failure consequences differ.

Specify which errors matter most before collecting results. In a low-risk drafting application, a stylistic omission may be tolerable; in a financial workflow, an unauthorized action or incorrect amount may demand a hard rejection. It is useful to distinguish severity from frequency. A rare but irreversible failure can dominate the release decision even when an average-quality score looks excellent.

A simple evaluation table can separate responsibilities:

Layer

Question the test must answer

Evidence

Input and access

Was the request authorized and properly scoped?

Identity, permission and test-tenant checks

Retrieval

Did the system find the right current source?

Relevant passages, versions and citations

Generation

Did the answer accurately use that evidence?

Rubric scores, claims and source comparison

Execution

Did any permitted tool perform the correct operation?

API result, idempotency and recorded business state

Operations

Did the workflow meet its service constraints?

Latency, error rate, recovery and unit cost

Build a dataset from real decisions and real exceptions

Public benchmark datasets are useful for broad capability comparisons, but they often lack the terminology, permissions and corner cases of a particular organization. Create a task-specific evaluation set from appropriately handled examples of genuine user questions, support incidents, policy decisions and known failures. Include ordinary requests as well as confusing instructions, missing attachments, conflicting documents, contradictory constraints, unusually long context and requests the assistant should decline.

For every item, record the user intent, allowed supporting evidence, expected handling, and the reason a wrong answer would matter. Some questions have a single correct value; others allow several acceptable wordings or workflows. Avoid writing a brittle string-exact answer key for an open-ended response when a structured rubric would capture correctness more fairly. Conversely, do not use an impressionistic rubric where a concrete numeric or legal condition must be exact.

Separate examples used to develop prompts from those used for final release testing. Otherwise a team may repeatedly tune its system against the same cases until the observed score rises without genuine generalization. Document dataset provenance, sensitive-data handling, sampling criteria and known gaps. When a model or application changes, retain stable regression cases but periodically add fresh examples so the test set reflects new products, documents and user behavior.

Retrieval quality is not the same as answer quality

In a retrieval-augmented generation system, evaluation should first ask whether the search found relevant, current and permitted documents. A model can only reason over the source passages it receives. If the answer requires a warranty exception that was dropped during chunking, a polished generation may never mention the exception. A model can also seem factual while citing an old version because the index treated it as equally authoritative.

Measure the relevance of retrieved chunks, whether required passages appear within the usable context, and whether untrusted or unauthorized material slips into the result. The RAG retrieval and vector design decisions—including chunk boundaries, metadata filters and source versioning—shape the evidence before generation begins. Test access revocation and stale-index scenarios separately from ordinary semantic search, since good top-k relevance does not establish confidentiality.

Next evaluate the answer’s faithfulness to that evidence. Did it make a claim the supplied passages did not support? Did it ignore a critical exception? Did it use the correct document version and cite the passage actually responsible for the conclusion? A response can be relevant to the question but not grounded, or grounded in available text yet incomplete for the business decision. Those defects should receive different labels so engineering teams know which component needs work.

Use automated scoring without outsourcing judgment

Automatic metrics work well for tasks with clear targets, such as classification accuracy or exact structured-field extraction. Text-similarity scores can be useful for certain summarization or question-answering comparisons, but they are imperfect substitutes for factual correctness. Two differently worded answers may both be valid, and two superficially similar answers may disagree on a crucial exception. Use the metrics whose assumptions match the actual output type.

Another large language model can serve as an evaluator. A judge model can score responses against a rubric and explain its assessment; Amazon Bedrock supports model-as-judge evaluation jobs alongside automated and human-based evaluation workflows. This can speed up screening and surface likely regressions, but a judge is still a model. It can overvalue eloquence, miss obscure technical failures, or systematically favor particular answer styles.

Calibrate automatic judging against a human-reviewed reference sample before using scores as release gates. Review cases where judges disagree, where a score changes unexpectedly and where a candidate model contradicts the source despite sounding persuasive. Domain experts should determine which rubric dimensions deserve strict thresholds. For high-consequence decisions, preserve deterministic assertions and independent system-of-record checks even when a judge produces a high confidence score.

Human review needs a reproducible protocol

Human evaluation is strongest when reviewers share a defined task, see the relevant evidence and use a practical scoring rubric. Ask them to assess factual completeness, clarity, compliance with authorized scope and suitability for the actual user. A reviewer who rates only whether an answer “sounds good” may miss subtle but dangerous omissions. Provide examples of acceptable, incomplete and disallowed responses before the main review begins.

For side-by-side comparisons, hide model or system names where possible and randomize presentation order. Otherwise brand reputation or familiarity can bias the assessment. Where the stakes warrant it, use more than one reviewer for a sample and reconcile material disagreements against the written rubric. Preserve reason codes rather than relying solely on a numerical average; “missing exclusion clause” is more actionable than “3 out of 5.”

Subject-matter review is particularly important for legal, financial, healthcare and regulated operational questions. The expert’s role is not simply to approve prose. It is to determine whether the evidence justifies the answer and whether the workflow remained within its intended scope. Keep the evaluated material within the organization’s authorized privacy and confidentiality process.

Test the business transaction, not the assistant’s claim about it

Agentic systems add a new failure class: a response may be grammatically correct while the system performed the wrong action. In a support assistant, the model may say “your ticket has been opened” when the API timed out. It may attempt the same update twice after a retry, choose the wrong account or act on a policy exception the user was not entitled to invoke. The evaluation must inspect real backend state and error handling, not merely the conversational transcript.

Use controlled test records to simulate success, authorization denial, validation failure, duplicate submission and partial completion. For each test, specify the expected tool call, allowed arguments, forbidden side effects and final system-of-record state. When a response differs from the actual state, fail that test even if the language is reassuring. The production evaluation incident approach connects retrieval errors, generation mistakes and transaction postconditions to one traceable investigation.

Operational requirements deserve the same rigor. A workflow that is accurate but times out during peak traffic may not be fit for production. Track end-to-end latency distributions rather than a single average, distinguish retries from successful initial calls, and measure cost per correctly completed task. Tests should include throttling, slow retrieval, temporary upstream failures and the behavior of any fallback model. A fallback that silently changes answer quality or permission behavior is not automatically safe.

Retest when models, documents or permissions change

Evaluation is not a one-time certification before launch. Models change, prompt templates evolve, documents are replaced, access groups are reorganized and new business processes create cases the original test set never covered. A deployment should record model version, prompt and policy version, retrieval index state, evaluation dataset version, and the corresponding application release. Otherwise a regression can be difficult to isolate when a score or customer complaint changes.

Build layered release gates. Run fast deterministic tests on each software change, broader offline model and retrieval evaluations for meaningful configuration updates, and controlled end-to-end exercises before significant deployments. After release, monitor anonymized or appropriately governed outcome samples and investigate incidents with their causal context. If a user reports a wrong answer, preserve enough evidence to distinguish incorrect retrieval, prompt interpretation, policy mismatch and tool failure.

A good operating dashboard does not need dozens of decorative scores. It needs a few measurements that lead to decisions: task completion, serious-error incidence, evidence quality, permitted-action correctness, latency and cost. Segment these by use case and relevant user population so an improvement for easy questions cannot conceal deterioration for a critical group or document type.

Turn evaluation into an engineering decision

A launch recommendation should describe the system’s intended tasks, the coverage of its tests, the most consequential known failures, and what operators will do when those failures occur. It should not claim that all model behavior has been proven safe. For a narrowly scoped read-only assistant, reasonable uncertainty handling and escalation may satisfy the requirement. For an agent executing irreversible actions, the release may depend on hard checks that cannot be relaxed by a better average quality score.

Foundation-model evaluation becomes valuable when it changes product decisions. It may show that a smaller model is sufficient for one task, that a retrieval filter is leaking outdated records, that a judge model overlooks critical omissions, or that the workflow needs a human approval step. These findings are more useful than a single headline score because they indicate what to fix, what to monitor and when not to ship.

Amazon AIP-C01: Foundation Model Evaluation A foundation model can perform impressively on a benchmark and still fail the task a company built it to do.
